A retrospective machine-learning study of 15,000 companies worldwide found that MFGCN, an end-to-end framework combining heterogeneous data fusion with spatiotemporal graph modelling, predicted enterprise financial crises with 89.1% accuracy, an F1-score of 0.862 and an area under the ROC curve of 0.896. The researchers reported that the model significantly outperformed the tested baseline approaches on a chronological test set covering 2019–2023. The study used a global multi-source dataset assembled from Orbis Global Enterprise Database, S&P Capital IQ, the GDELT news-event database and FactSet supply-chain data.

After preprocessing, the researchers constructed 36 quarterly graph snapshots from 2015 through 2023 for 15,000 enterprises, representing 40% in North America, 35% in Europe and 25% in Asia across 11 Global Industry Classification Standard sectors. The 2015–2018 observations were used for training and 2019–2023 for testing. MFGCN was designed to classify whether an enterprise would experience a defined crisis event within a future warning period.

Positive labels were assigned when a company recorded debt default, bankruptcy or special treatment of its shares; other sampled enterprises were treated as negative cases. The sampled data had an approximate positive-to-negative ratio of 1:9, creating substantial class imbalance. The principal experiments used an eight-quarter input window and a two-quarter warning lead time, with five repeated evaluations.

The framework has separate but connected stages for aligning and fusing heterogeneous inputs and for modelling enterprise relationships. For the data-fusion stage, a graph-neural-network matching method aligned fields across data schemas, while DeBERTa-based encoding and similarity calculations supported entity linking. An attention mechanism then assigned dynamic weights to source-specific representations, including structured financial information and unstructured public-opinion text.

The resulting fused features were used to construct a dynamic graph containing supply-chain, guarantee, equity-investment and capital-flow edges. For spatiotemporal prediction, a relational graph convolutional network aggregated information across the different edge types, and a gated recurrent unit modelled changes across successive quarters. The authors trained the complete framework end to end with focal loss and L2 regularisation, using Adam and early stopping.

Comparisons included logistic regression, random forest, XGBoost, static GCN, LSTM, R-GCN and ATT-Fusion. Reported F1-score and AUC differences between MFGCN and the baseline models were significant at p<0.01 in the five-replicate paired tests. Additional evaluation covered an auxiliary dataset of 3,000 Chinese A-share companies from 2015–2023, containing only structured financial data and equity relationships.

MFGCN obtained an F1-score of 0.845 and AUC of 0.886 there, improving on the best ATT-Fusion baseline by 2.6 percentage points in F1-score and 2.1 points in AUC. The reported paired tests for these differences were significant for F1-score (t=4.12, p=0.004) and AUC (t=3.89, p=0.006). The robustness experiments added Gaussian noise with a standard deviation of 0.3 to test-set node features and repeated the procedure 10 times.

MFGCN’s reported average performance degradation was 4.2%. At warning lead times extended from one to four quarters, its AUC declined across all models, but MFGCN retained an AUC of 0.861 at four quarters. In held-out-domain tests that excluded cryptocurrency-related companies or Latin American companies from training, the reported performance decrease was no more than 4.52%.

Interpretability was assessed using SHAP values, feature-importance stability measures and a blind expert review of 100 high-risk predictions. The study also described an example in which a model-highlighted path connected an upstream supplier’s production halt with a downstream customer’s material shortage, reduced production capacity and deteriorating cash flow, followed by a credit-rating downgrade. This was a model-generated, descriptively verified example rather than a causal evaluation.

The results remain subject to important limitations. The graph structure depends on the completeness, accuracy and timeliness of enterprise relationships, and the model retains considerable computational cost: the reported implementation had 14.1 million parameters, required about 0.55 hours per training epoch on an NVIDIA V100 GPU with 64 GB RAM, and took 55 hours for 100 epochs. Its reported inference time was 5.2 milliseconds per sample.

The authors also identified extreme class imbalance and the need for more robust loss functions as unresolved issues, and proposed future work on dynamic graph updating, efficiency methods and federated learning. The evidence therefore supports MFGCN’s performance in the study’s retrospective datasets, not a general guarantee of performance in prospective enterprise risk systems.
