A hybrid CatBoost pipeline using synthetic sampling and optimized class weights achieved the strongest reported classification results in a 258-record study of drilling-related lost circulation at Iraq’s Buzergan oil field.

A hybrid, data-centric machine-learning framework outperformed standalone imbalance-handling and ensemble methods in a study of lost-circulation prediction during drilling. The research used 258 operational records from the Buzergan oil field in southern Iraq, where severe class imbalance and limited data complicate prediction of lost-circulation severity. The strongest reported classification result came from CatBoost combined with Synthetic Minority Oversampling Technique, or SMOTE, and optimized custom class weights. Across accuracy, weighted F1, Matthews Correlation Coefficient and weighted area under the curve, the hybrid approach performed more effectively than either oversampling or ensemble learning alone.

The dataset combined drilling parameters, mud properties and geological indicators, allowing the researchers to examine whether several kinds of operational and subsurface information could jointly support a multiclass prediction task. Its 258 records were not evenly distributed among severity classes, leaving the minority categories underrepresented relative to the majority class. The study was designed specifically around that small-sample, highly skewed structure rather than assuming that a conventional machine-learning pipeline would provide reliable performance. Its staged workflow first generated additional examples for minority classes and then applied imbalance-aware weighting, with each component building on the preceding stage.

A distinctive feature of the method was the treatment of class weights as tunable hyperparameters rather than a fixed correction. The researchers calculated weights from the original class distribution and transferred them to the synthetically augmented data, thereby preserving the imbalance structure of the source records while increasing sensitivity to minority classes. This sequence differs from methods that either generate synthetic examples or adjust class weighting in isolation. The authors also used Optuna with a Tree-structured Parzen Estimator for hyperparameter tuning, then assessed the models through strict stratified cross-validation and clean hold-out testing to reduce the risk of data leakage.

For the best-performing hybrid configuration, the study reported an accuracy of 0.8846, a weighted F1 score of 0.8651 and a Matthews Correlation Coefficient of 0.8236. The same CatBoost–SMOTE configuration with optimized class weights achieved a weighted area under the curve, or AUC-W, of 0.9154. A separate stacking ensemble produced the highest ranking result, with AUC-W of 0.934. The study therefore found that the leading configuration depended on the evaluation measure: the hybrid CatBoost model led on the reported classification metrics, while the stacking ensemble showed superior ranking performance. These results are model-specific findings from one small operational dataset, rather than proof that the same performance will occur under different drilling conditions or in other fields.

The work offers a practical template for drilling datasets in which rare outcomes can be obscured by a dominant class. Its approach is data-centric: synthetic sampling, class-weight optimization and ensemble learning are integrated sequentially, and the evaluation explicitly accounts for multiclass imbalance through MCC alongside accuracy, weighted F1 and AUC-W. The authors identify transferability to other oil fields as an important next step, meaning that validation of the trained models elsewhere remains necessary. The study does not establish a new physical cause of lost circulation or demonstrate a field intervention; instead, it shows that a carefully structured machine-learning pipeline can improve the prediction of severity categories from a limited and unevenly distributed collection of drilling and geological records.
